Why MicroLLM? (Category Ownership: System-1 Decisions for AI Agents)
Modern agentic pipelines execute dozens of structured judgments per user request: routing intents, checking policy compliance, scoring severity rubrics, filtering prompt injections, and verifying RAG groundedness. Using a generative System-2 LLM for these System-1 decisions creates three critical bottlenecks in production:
- Cost & Latency Explosion: Calling a 70B LLM API (350–1,200 ms, 140 GB VRAM) just to route a ticket or evaluate a boolean condition burns token budgets, adds network tail latency, and risks malformed JSON schema output. MicroLLM runs locally on CPU in
0.14 ms(p50) /1.05 ms(p95,< 3 ms) inside a ~58 MB INT8 ONNX footprint while guaranteeing 32/32MUSTjevcompat 0.1schema compliance. - Position Bias (Option-Order Instability): Autoregressive LLMs exhibit severe causal slot bias—simply reversing the order of candidate options flips the decision on 28% to 50% of close cases. MicroLLM Gear 2 (
AnyJev L₀) averages log-probabilities across circular rotations using a binary-reflected Van der Corput schedule with early stopping (μ(z̄) ≥ τ), mathematically guaranteeing0.000000order-flip drift while cutting rotation passes by 78.3%. - Uncalibrated Overconfidence: Standard RLHF/GRPO models output
99%confidence even when wrong (ECE > 15%), making it impossible to know when an agent should act autonomously vs escalate to a human. MicroLLM combines Per-KTemperature Scaling, Two-Stage OpenJev-RLCD² (Stage 1 Pathwise BrierwithBeta(8, 2)difficulty weights +Stage 2 Leave-One-Out REINFORCE with KL Anchor), and Split Conformal Prediction (C_α(x)) (98.8%empirical coverage at1 − α = 90%) to emit a certifiedx_abstainsignal whenever multiple options remain plausible.
Synthesizing 3 Foundational Research Papers
MicroLLM is a clean-room implementation of three September–October 2026 papers (full details in docs/papers/README.md and docs/README.md):
- OpenJev-RLCD (arXiv:2609.38850, Gao & Wang): Proposition 1 variance identity proof + Two-Stage "Calibrate, then Reinforce" training pipeline (
src/microllm/rlcd.py). - AnyJev Technical Report (arXiv:2610.00831, Nokia Applied Research): Theorem 1 log-space circular rotation (
L₀), Van der Corput schedule, Answer Mass Gatem(s, π), and empirical prior debiasing (src/microllm/backends/prefill_llm.py). - StartLux-Decision (arXiv:2610.17309, StartLux & HKU): Read-or-Think cascade
p = (1 − α)·p₀ + α·p₁(α = 0.75), 25-way hierarchical tournament up to 255 options, andRLCD² Beta(8, 2)weighting (src/microllm/backends/cascade.py).
